Deep LearningGradient Flow

How does gradient clipping stabilize neural network training?

Gradient clipping stabilizes neural network training by limiting excessively large gradients before the optimizer updates the model weights.

This is especially useful when training suffers from the exploding gradient problem.

What happens without clipping?

If a gradient becomes extremely large, the weight update can also become extremely large:

weight update = learning rate × gradient

A huge update can push the model far away from a useful region of the loss surface and cause:

  • Unstable loss values
  • Large oscillations
  • Divergence
  • Numerical overflow or NaN values

What does gradient clipping do?

Gradient clipping places a limit on the gradient before the optimizer uses it.

Two common approaches are:

  • Clip by value: restrict each gradient component to a fixed range.
  • Clip by norm: scale the whole gradient vector when its norm exceeds a threshold.

Example: clipping by norm

Suppose the gradient norm is:

20

and the clipping threshold is:

5

The gradient is scaled down so its norm becomes 5, while its overall direction is preserved.

This prevents one unusually large gradient from producing a destructive update.

Why does this stabilize training?

Gradient clipping helps keep parameter updates within a manageable range.

It does not remove the underlying cause of exploding gradients, but it acts as a safeguard that prevents those gradients from destabilizing optimization.

Where is it commonly used?

Gradient clipping has historically been especially useful in recurrent neural networks and other models where gradients can grow rapidly across many computational steps.

It can also be useful in other deep networks when occasional gradient spikes occur.

For the basic concept, see “What is gradient clipping?” and for the underlying issue see “Why can gradients become very large in deep networks?”.

In short, gradient clipping stabilizes training by limiting unusually large gradients so the optimizer cannot make excessively large and destructive parameter updates.
