Large Language ModelsPost-Training & Alignment

What is RLHF in Large Language Models?

RLHF stands for Reinforcement Learning from Human Feedback.

It is a post-training technique used to make an LLM prefer responses that better match human judgments about qualities such as helpfulness, relevance, safety, and instruction following.

Why is RLHF used?

A pretrained model learns to predict likely text.

Even after supervised fine-tuning, it may still produce several possible answers with very different quality.

RLHF adds another signal:

Which response do people prefer?

The model is then trained to make preferred responses more likely.

What role does human feedback play?

People are shown multiple responses to the same prompt and asked to rank or compare them.

For example:

Prompt
  ↓
Response A
Response B
  ↓
Human preference:
A > B

These comparisons create preference data.

What is the basic RLHF pipeline?

A common RLHF pipeline contains three broad stages:

supervised fine-tuned model
        ↓
collect human preferences
        ↓
train a reward model
        ↓
reinforcement-learning optimization
        ↓
better-aligned model

The exact implementation can vary.

What is a reward model?

A reward model learns to predict which responses humans are likely to prefer.

Instead of asking a human to score every response during training, the reward model provides an automated preference score.

For example:

Prompt + response
      ↓
reward model
      ↓
reward score

The language model can then be optimized to produce responses with higher reward.

Why use reinforcement learning?

Once the reward model can score responses, reinforcement learning can adjust the LLM so it becomes more likely to generate responses that receive higher scores.

The model effectively learns:

generate response
      ↓
receive reward
      ↓
update behavior

What kinds of behavior can RLHF improve?

Depending on the preference data and training criteria, RLHF can help improve:

  • Instruction following
  • Helpfulness
  • Relevance
  • Response quality
  • Safety behavior
  • Tone
  • Conversational consistency

Is RLHF the same as supervised fine-tuning?

No.

Supervised fine-tuning teaches from desired example responses.

RLHF teaches from preferences between possible responses and then uses a reward signal to optimize the model.

A simple distinction is:

SFT:
"Produce responses like this."

RLHF:
"Prefer this response over that one."

Does RLHF always require a reward model?

Traditional RLHF commonly uses one, but modern preference-optimization methods can take different approaches.

For example, DPO can optimize from preference pairs without a separate learned reward model in the same training loop.

That difference is covered separately in “What is Direct Preference Optimization (DPO)?”

What are the limitations of RLHF?

RLHF depends heavily on the quality of its preference data.

Potential problems include:

  • Annotator disagreement
  • Reward-model errors
  • Over-optimization toward the reward
  • Excessive agreeableness
  • Overly cautious behavior
  • Reduced performance on some tasks

So RLHF is usually combined with careful evaluation and additional safety testing.

In short: RLHF uses human preference comparisons to train a reward signal and then applies reinforcement learning to make an LLM more likely to produce responses that people judge as better.
